Introduction to Graph Algorithms

Throughout the preceding modules in this chapter, we've built a comprehensive understanding of graph data structures: their formal definitions, representation strategies, properties, and modeling patterns. We've learned to see graphs everywhere—in social networks, transportation systems, dependency hierarchies, and state machines.

But representation is only half the story. The true power of graphs emerges when we apply algorithms to them. A graph sitting in memory is just data; algorithms transform that data into answers, insights, and solutions.

This page provides a strategic overview of the algorithmic landscape for graphs. Before diving deep into any single algorithm, we need to understand what categories of problems these algorithms solve, how they relate to each other, and why certain algorithms are suited to certain problem types. This bird's-eye view will serve as your conceptual map for the upcoming chapters dedicated to graph algorithms.

Graph algorithms represent one of the most extensively studied areas in computer science. From the earliest days of computing, researchers recognized that graphs model an enormous variety of real-world problems, and efficient algorithms for graph problems unlock solutions across domains.

Why are graph algorithms so important?

Graphs are the universal language for describing relationships. Once you model a problem as a graph, you gain access to decades of algorithmic research. A web crawler navigating the internet, a GPS finding the fastest route, a compiler ordering build dependencies, and a social network suggesting friends—all reduce to graph algorithms.

Let's establish the major categories:

Before diving into specific algorithms, let's crystallize the fundamental questions that drive graph algorithm design. Each question represents a category of problems, and understanding these questions helps you recognize which algorithm applies to a new problem.

Question 1: How do we systematically explore a graph?

This is the traversal problem. Given a starting vertex, how do we visit every reachable vertex exactly once? The two canonical answers—Breadth-First Search (BFS) and Depth-First Search (DFS)—represent fundamentally different exploration strategies:

• BFS explores level by level, visiting all neighbors before moving deeper. This naturally finds shortest paths (in terms of edge count) and is ideal for "discovery" scenarios where proximity matters.

• DFS explores as deep as possible first, backtracking only when necessary. This is ideal for detecting cycles, topological sorting, and problems requiring path-based reasoning.

Question 2: What is the cheapest path between two vertices?

This is the shortest path problem. In weighted graphs, edges have costs, and we want the path with minimum total cost. Different algorithms address different scenarios:

• Single-source, non-negative weights: Dijkstra's algorithm
• Single-source, negative weights allowed: Bellman-Ford algorithm
• All-pairs shortest paths: Floyd-Warshall algorithm

The choice depends on whether your graph has negative weights, whether you need paths from one source or all sources, and your performance requirements.

Question 3: How do we connect all vertices at minimum cost?

This is the minimum spanning tree (MST) problem. Given a weighted graph, find a subset of edges that connects all vertices with no cycles and minimum total weight. Applications range from network design to clustering algorithms:

• Prim's algorithm: Grows the tree from a single vertex
• Kruskal's algorithm: Greedily adds edges in weight order

Both achieve optimal results; the choice often depends on graph representation and density.

Graph algorithms share common building blocks—data structures and techniques that appear repeatedly. Understanding these components helps you comprehend new algorithms faster and recognize opportunities for optimization.

1. Visited/Seen Tracking

Nearly every graph algorithm needs to track which vertices (or edges) have been processed. This prevents infinite loops in cyclic graphs and ensures each element is handled exactly once. Implementations vary:

• Boolean array for vertex indices: O(1) lookup, O(V) space
• Hash set for arbitrary vertex identifiers: O(1) average lookup
• Bit vector for memory-critical applications: Same semantics, less space

2. Priority Queues (Heaps)

Many graph algorithms require processing vertices or edges in order of some priority—typically cost or distance. Priority queues (usually binary heaps) enable:

• O(log n) insertion
• O(log n) extraction of minimum/maximum
• Essential for Dijkstra, Prim, and many greedy algorithms

3. The Relaxation Principle

A core concept in shortest path algorithms is relaxation—the process of improving an estimate. Initially, we assume all paths are infinite. When we discover a shorter path through an edge, we "relax" that estimate:

if dist[u] + weight(u, v) < dist[v]:
    dist[v] = dist[u] + weight(u, v)

Dijkstra and Bellman-Ford both use relaxation; they differ in the order and number of times they relax edges.

4. Union-Find (Disjoint Set Union)

For problems involving connectivity and component management, Union-Find provides near-constant time operations for:

• Determining if two vertices are in the same component
• Merging two components

This is essential for Kruskal's MST algorithm and connectivity checking.

Graph algorithms are not isolated techniques—they form a connected web of ideas where understanding one illuminates others. Let's trace the relationships:

BFS → Dijkstra

BFS finds shortest paths when all edge weights are equal (or 1). Dijkstra generalizes this to arbitrary non-negative weights. The key insight: BFS uses a simple queue because all edges have equal cost; Dijkstra uses a priority queue to always process the vertex with minimum distance first.

BFS: Queue orders by discovery time (FIFO)
Dijkstra: Priority queue orders by accumulated distance

If you set all weights to 1 in Dijkstra's algorithm, it behaves exactly like BFS.

Dijkstra → Bellman-Ford

Dijkstra assumes non-negative weights. If you have negative weights, Dijkstra's greedy assumption ("once processed, a vertex's distance is final") fails. Bellman-Ford relaxes this assumption by potentially re-processing vertices, allowing it to handle negative weights—at the cost of higher time complexity.

Dijkstra: O(E log V), non-negative weights only
Bellman-Ford: O(V × E), handles negative weights, detects negative cycles

DFS → Topological Sort → Cycle Detection

DFS provides the foundation for topological sorting (ordering tasks by dependencies) and cycle detection. The "finish time" of vertices in DFS directly yields topological order in DAGs. If we encounter an edge to an unfinished vertex during DFS, we've found a cycle.

Prim ↔ Kruskal

Both Prim's and Kruskal's algorithms solve the MST problem, but from different perspectives:

• Prim grows a tree from a starting vertex, always adding the minimum-weight edge that connects a tree vertex to a non-tree vertex.

• Kruskal processes edges globally in weight order, adding each edge that doesn't create a cycle.

Both are greedy and both are optimal. Prim tends to be more efficient for dense graphs (where adjacency matrices shine), while Kruskal is often preferred for sparse graphs (edge list representation).

The Spanning Tree Connection

Here's a subtle but important relationship: BFS and DFS both produce spanning trees of the connected component they explore. BFS produces a tree with minimum depth from the root. DFS produces a tree that reflects the exploration order. MST algorithms produce a spanning tree with minimum total edge weight. Different objectives, same underlying structure.

Understanding the time and space complexity of graph algorithms is crucial for choosing the right algorithm and predicting performance. Here's a consolidated view of the algorithms we'll study in depth:

Notation reminder:

• V = number of vertices
• E = number of edges
• For connected graphs: E ≥ V - 1
• For dense graphs: E ≈ V²
• For sparse graphs: E ≈ V

Practical Implications

These complexities have real-world implications:

For BFS and DFS: With O(V + E) complexity, traversal algorithms are remarkably efficient. A graph with 1 million vertices and 10 million edges can be fully traversed in tens of milliseconds on modern hardware. This is why web crawlers and social network analysis at scale are feasible.

For Dijkstra: The O((V + E) log V) complexity means performance depends heavily on edge density. For sparse graphs (E ≈ V), this is nearly O(V log V)—excellent. For dense graphs (E ≈ V²), this becomes O(V² log V). GPS systems with millions of road segments rely on highly optimized Dijkstra variants.

For Bellman-Ford: The O(V × E) complexity is significantly worse than Dijkstra, but it's necessary when negative weights exist. In practice, Bellman-Ford is reserved for graphs where negative cycles might occur (financial arbitrage detection, for instance).

For Floyd-Warshall: The O(V³) complexity limits Floyd-Warshall to moderately sized graphs (thousands of vertices, not millions). However, it computes all-pairs shortest paths, which would require running Dijkstra V times (O(V² log V + VE) for comparison).

One of the most valuable skills in applying graph algorithms is recognition—seeing a problem and immediately knowing which algorithmic category applies. Here's a diagnostic guide:

If your problem involves:

Real-World Problem Translation:

As you study graph algorithms, be aware of common misconceptions and errors that trip up learners and practitioners alike:

Pitfall 1: Using Dijkstra with Negative Weights

This is the most common algorithmic error. Dijkstra's greedy assumption—that once a vertex's distance is finalized, it won't change—fails with negative weights. A negative edge can create a shorter path through an already-processed vertex.

Pitfall 2: Forgetting to Track Visited Vertices

In graphs with cycles, failing to mark vertices as visited leads to infinite loops. Always maintain a visited set and check before processing.

Pitfall 3: Off-by-One in Index-Based Representations

If your vertices are numbered 0 to V-1, ensure your arrays are sized correctly and your loops iterate over the right range. Similarly, if vertices are numbered 1 to V, adjust accordingly.

Pitfall 4: Confusing Directed and Undirected Edge Addition

For undirected graphs, adding an edge (u, v) requires adding both graph[u].push(v) and graph[v].push(u). Forgetting the reverse direction is a common bug.

Pitfall 5: Modifying Priority Queue Entries Incorrectly

In Dijkstra's algorithm, when you find a shorter path, you need to update the priority queue. Standard heaps don't support decrease-key efficiently. The common workaround is adding a new entry and ignoring stale ones when extracted:

// When extracting from priority queue:
const [dist, vertex] = pq.extractMin();
if (dist > distances[vertex]) continue; // Stale entry, skip

Pitfall 6: Assuming All Graphs Are Connected

Many algorithms assume a connected graph. If your graph might have multiple components, you need to run traversal from each unvisited vertex to cover them all.

We've surveyed the landscape of graph algorithms, establishing the conceptual framework for the deep dives ahead. Let's consolidate the key ideas:
